You Ask, I Answer: Solving the AI Personalization Cold Start

Summary

In today's episode, I walk through how to solve the cold start problem for AI personalization when you have zero behavioral data on new users. Here's what this means for you. You'll gain a practical framework for bootstrapping personalization using synthetic AI agents instead of forcing users through rating screens. You'll also learn these concepts: how to build ideal customer profiles and deploy AI browser agents as virtual focus groups, why generative AI simulates consumer behavior with about 90% accuracy on language-based tasks, and how to weight your algorithms so real user data eventually dominates the synthetic seed.

Key Takeaways

  • You'll learn how to create ideal customer profiles and have AI browser agents browse your platform as synthetic personas to generate cold start behavioral data
  • You'll discover why generative AI simulates language-based consumer behavior with roughly 90% accuracy and how that buys you about 30 days of usable seed data
  • You'll see how to build weighting algorithms that give real user signals about 75% more priority than synthetic data once actual sessions start flowing in

In today's episode, Joel asks, how do we solve the cold start problem for AI personalization when a platform has zero behavioral data on new users? I'm building a content recommendation feature. The problem I keep running into is that we have zero behavioral signal on new users, so their first session is just generic top and final content. I can't ask users to rate 20 items on sign-up like Netflix used to. How do you bootstrap personalization for new users without behavioral data?

Uh it depends on your platform, and you didn't specify what kind of platform it is, but you should have something like an ideal customer profile, right? Especially if you are, if you have if you know that who your service or your product appeals to, you should have an ideal customer profile. You should, from that ideal customer profile, be able to create some automations, some uh synthetic browsers. And what you would do is you would take those synthetic browsers, give them access to to a web browser, give them access to your platform or your service or what have you, and have them act as though they are those people, right? The synthetic people.

Have them make choices. You would work with a browser like uh you can use do this in Gemini, you can do it in Claude, you can do it in OpenAI Codex, you can for sure do it in models like Quen3 VL, etc. that have great browsing capabilities. You're going to have AI agents use your products and services like real customers. Give them those detailed ideal customer profiles of who you want as customers and have them act as them.

Have them behave like them to develop some initial behavioral profiles. Right? So you're not going to keep this running. This is the cold start. You'll do this up front, you'll get this going, and then once it's going, and you have some profiles for people to as proxies for real people, you will then over time substitute in the real behavioral data.

So let's say you have a I'm gonna make this up a service that serves plumbers, and you don't have any real plumbers that you can launch with, and you don't have any capital to hire a real plumber to use your service and give you feedback. You would create five or six ideal customer profiles for the different kinds of plumbers, right? Commercial, industrial, residential, small job, big uh holding company, whatever the thing that's gonna be. From that, you will then have the synthetic plumber personalities, and you might, by the way, inform some of those ideal customer profile personalities with real user data from other places. Um, get yourself a Reddit developer's API key and scrape the plumbing for them, right?

Use that data to inform things like language and choices that your fake plumber is going to likely do, and then put it through your system. Have your system have your your AI agents behave like those plumbers, perform those actions, give you synthetic feedback. Oh, I like this, I didn't like this. You can have AI be a virtual focus group, right? You can have AI say, yeah, this didn't really work for me, or this was great, or what have you, and build those behaviors to start.

Once you have that, then that goes into your personalization system. That is your cold start data. Serve up the things that are most likely based on what your AI agents did because. Because back in 2025, I can't remember which company did it, but a company did a study that showed that generative AI, when working with qualitative data like language and stuff like that, simulates consumer purchase behavior with about a 90% accuracy rate when it is language-based. So you would have your ICP, your synthetic ICP browse your site and then give you word feedback.

What did you like? What did you not like? And that, and you can then build your behavioral data from that. So that's how I would tackle this problem. It's an interesting problem.

And we know from proven studies that machines can simulate those behaviors enough to give you 30 days of cold start behavior, synthetic behavior, and then you start swapping in the real data. And make sure when you do start getting real data in your algorithms in your backend code, you have a priority indicator that gives like 75% more weight to real people data versus your synthetic data, because otherwise you will have the synthetic data will over influence because it's first in the data set. So you need to create weighting algorithms that say, let's give the synthetic data a penalty and prioritize the real people data. But that's how you get started. I don't uh as I said, I don't know what your system is.

I don't know how it works, so I can't give you more detail than that, but that's how I would approach the problem. And it's an interesting problem. So good luck. Thanks for the question. Talk to you on the next one.
